Physics-based Covariance Models for Gaussian Processes with Multiple Outputs

چکیده
Gaussian process analysis of processes with multiple outputs is limited by the fact that far fewer good classes of covariance functions exist compared with the scalar (single-output) case. To address this difficulty, we turn to covariance function models that take a form consistent in some sense with physical laws that govern the underlying simulated process. Models that incorporate such information are suitable when performing uncertainty quantification or inferences on multidimensional processes with partially known relationships among different variables, also known as co-kriging. One example is in atmospheric dynamics where pressure and wind speed are driven by geostrophic assumptions (wind ∝ ∂/∂x pressure). In this study we develop both analytical and numerical auto-covariance and cross-covariance models that are consistent with physical constraints or can incorporate automatically sensible assumptions about the process that generated the data. We also determine high-order closures, which are required for nonlinear dependencies among the observables. We use these models to study Gaussian process regression for processes with multiple outputs and latent processes (i.e., processes that are not directly observed and predicted but interrelate the output quantities). Our results demonstrate the effectiveness of the approach on both synthetic and realistic data sets.

Dependent Gaussian Processes
Gaussian processes are usually parameterised in terms of their covariance functions. However, this makes it difficult to deal with multiple outputs, because ensuring that the covariance matrix is positive definite is problematic. An alternative formulation is to treat Gaussian processes as white noise sources convolved with smoothing kernels, and to parameterise the kernel instead. Using this, ...
متن کاملEfficiency evaluation of wheat farming: a network data envelopment analysis approach
Traditional data envelopment analysis (DEA) models deal with measurement of relative efficiency of decision making units (DMUs) in which multiple-inputs consumed to produce multiple-outputs. One of the drawbacks of these models is neglecting internal processes of each system, which may have intermediate products and/or independent inputs and/or outputs. In this paper some methods which are usab...
متن کاملMultivariate Gaussian Process Emulators With Nonseparable Covariance Structures
Gaussian process regression models or ‘emulators’ have become popular in the statistical analysis of deterministic computer models (simulators), in particular for computationally expensive models where the emulator is used as a fast surrogate. For models with multivariate output, common practice is to specify a separable covariance structure for the Gaussian process. Though computationally conv...
متن کاملComputationally Efficient Convolved Multiple Output Gaussian Processes
Recently there has been an increasing interest in regression methods that deal with multiple outputs. This has been motivated partly by frameworks like multitask learning, multisensor networks or structured output data. From a Gaussian processes perspective, the problem reduces to specifying an appropriate covariance function that, whilst being positive semi-definite, captures the dependencies ...
متن کاملGaussian Processes for Regression and Optimisation
Gaussian processes have proved to be useful and powerful constructs for the purposes of regression. The classical method proceeds by parameterising a covariance function, and then infers the parameters given the training data. In this thesis, the classical approach is augmented by interpreting Gaussian processes as the outputs of linear filters excited by white noise. This enables a straightfor...
